Why Pure Vector Search Fails: Supercharging RAG with Hybrid Search on AWS
Standard semantic vector search often stumbles over exact product codes, error IDs, and specific SKUs. Discover how combining dense embeddings with BM25 keyword matching via Amazon OpenSearch creates accurate, production-grade RAG systems.
When developers build their first Retrieval-Augmented Generation (RAG) prototype, the architecture is usually straightforward: convert text documents into vector embeddings, store them in a vector database, and query using cosine similarity.
In simple demos, this works like magic. But in enterprise environments, pure semantic search frequently fails to deliver the right answers.
The Problem: When Semantic Search Loses Precision
Dense vector embeddings represent the semantic meaning of a sentence. They excel at mapping broad concepts—understanding that "laptop battery dying quickly" is conceptually related to "poor battery life."
However, semantic embeddings struggle with exact lexical matches:
- Part numbers & SKUs: Searching for
EC2-m6i.4xlargemight accidentally retrieve documentation forc6i.4xlargebecause their conceptual embeddings are nearly indistinguishable. - Error codes: Queries containing specific runtime errors like
ERR_CONNECTION_TIMED_OUTorHTTP 403can get overshadowed by general networking summaries. - Acronyms and names: Proprietary acronyms or internal project codenames often confuse general embedding models.
When your RAG pipeline retrieves the wrong chunk, your Large Language Model (LLM) will hallucinate or generate inaccurate answers—no matter how capable the model is.
The Fix: What Is Hybrid Search?
Hybrid Search unites the best of two search paradigms:
- Sparse / Lexical Retrieval (BM25): Matches exact keywords, technical terms, error codes, and unique IDs with high precision.
- Dense / Vector Retrieval: Captures intent, synonyms, context, and semantic meaning.
