Building Context-Aware AI Applications with (RAG) Using Amazon Bedrock

Build context-aware AI applications using Amazon Bedrock and Retrieval-Augmented Generation (RAG). Ingest private documents, retrieve relevant knowledge, and generate accurate, grounded answers with citations. Bedrock Knowledge Bases handle chunking, embeddings, and semantic search without infrastructure. Add Guardrails and contextual grounding to improve safety, compliance, and reduce hallucinations for enterprise AI.

Sharing, Learning, Growing Together
Generative AI has revolutionized how humans interact with information, helping us summarize documents, draft content, answer questions, and automate tasks. But despite their power, large language models (LLMs) face a critical limitation: they cannot “know” everything. They only generate answers based on what they were trained on, which is often public data and internet text. As a result, they struggle when asked about private enterprise knowledge, technical internal documentation, regulatory policies, or customer data.
Organizations across finance, healthcare, retail, legal, and engineering generate large volumes of unstructured internal documents standard operating procedures, product knowledge, incident runbooks, manuals, meeting transcripts, legal filings, support tickets, financial statements, and more. These documents hold valuable information, but they are difficult to search, slow to navigate, and time-consuming to analyze manually.
Traditional LLMs are not ideal for such tasks because:
  • They hallucinate answers when missing context
  • They cannot automatically access private documents
  • Fine-tuning models on proprietary data is expensive and slow
  • Enterprise users need traceable answers with citations
  • Many industries require data governance, privacy, and safety
  • Regulatory environments demand high accuracy
Once the documents are successfully ingested, your knowledge base becomes search-ready. Any incoming query is passed through the retrieval layer, which performs a similarity search against the vector store and returns the most relevant text snippets. These results are then used as context to augment the LLM prompt, enabling accurate, grounded responses that are based on your private data rather than model hallucinations.

Retrieval-Augmented Generation (RAG): The Bridge Between LLMs and Enterprise Knowledge

Retrieval-Augmented Generation (RAG) solves this challenge by pairing a foundation model with an internal knowledge retrieval system. Instead of depending on what the model already knows, RAG dynamically:
  1. Searches enterprise documents using semantic or hybrid similarity
  1. Retrieves the most relevant text passages
  1. Adds those passages as context alongside the user question
  1. Generates a natural-language answer grounded in real evidence
This means the model no longer needs to “invent” answers; it reasons based on retrieved truth, improving accuracy and reducing hallucinations. Importantly, it also preserves privacy, because the retrieved data never becomes part of the model’s weights.
RAG = Generative reasoning + private knowledge retrieval + grounded transparency

Amazon Bedrock Knowledge Bases: Managed RAG Without Infrastructure Complexity

RAG systems have traditionally required heavy engineering:
  • Designing chunking algorithms
  • Building embedding pipelines
  • Hosting vector databases
  • Managing sync jobs
  • Handling metadata indexing
  • Building a retrieval layer
  • Orchestrating prompt augmentation
Each part is a scalable production system on its own.
Amazon Bedrock Knowledge Bases abstracts all of this into a fully managed RAG service, enabling teams to focus on business features rather than ML plumbing.
With Knowledge Bases, you:
  • Ingest documents from S3, Salesforce, SharePoint, Confluence, or Web
  • Automatically chunk, embed, and vectorise them using Titan Embeddings
  • Store embeddings securely in OpenSearch Serverless (AOSS)
  • Query the knowledge base through simple Bedrock APIs
  • Retrieve, augment, and generate answers with built-in grounding
  • Get citations, metadata, and traceability as part of the output
A single Knowledge Base can be used to:
  • Power chat experiences
  • Build Q&A engines
  • Automate operational reasoning
  • Support enterprise search
  • Enable agent orchestration with memory
  • Drive reporting and compliance analytics

Problem & Solution Perspective

The Core Problem

Internal knowledge is valuable but difficult to navigate:
  • Employees manually search SharePoint, Confluence, and file systems
  • Customer support teams train on large internal manuals
  • Legal and regulatory organizations need strict document traceability
  • Fine-tuning LLMs on private data is costly and risky
  • Hallucinations create compliance and reputational risk
Moreover, without grounding:
  • LLMs can generate incorrect answers with confidence
  • Answers lack citations and cannot be verified
  • Sensitive internal content may be exposed without policy enforcement

The Solution: Context-Aware RAG on Bedrock

Bedrock Knowledge Bases solve these by combining:
  • accurate internal retrieval
  • grounded response generation
  • enterprise data privacy
  • safety guardrails and compliance
  • full transparency and citations

End-to-End Workflow

1. Data Ingestion

  • Upload files into S3 or connect Salesforce, SharePoint, Confluence, or Web
  • Start ingestion jobs from the Bedrock console or API
  • Knowledge Bases automatically:
  • Parse documents
  • Chunk text intelligently
  • Generate embeddings
  • Store vectors into AOSS
  • Attach metadata for filtering

2. Querying the Knowledge Base

Two retrieval approaches:

A. Fully Managed RAG — RetrieveAndGenerate

  • User asks a question
  • Bedrock:
  • embeds query
  • retrieves top-k chunks
  • forms augmented prompt
  • generates a grounded answer using LLM
  • Output returns:
  • answer text
  • citations
  • retrieved evidence

B. Custom RAG — Retrieve API

  • Only retrieve relevant chunks and metadata
  • Developer controls:
  • prompt formatting
  • multi-hop reasoning
  • ranking logic
  • chain-of-thought structure
  • agent workflows
Advanced RAG systems typically:
  • filter chunks by metadata
  • chain multiple retrieval passes
  • perform analytics before answering
  • route queries to different models for cost and accuracy

Creating the Knowledge Base

plaintext
knowledge_base = BedrockKnowledgeBase(
kb_name=knowledge_base_name,
kb_description=knowledge_base_description,
data_sources=data_sources,
chunking_strategy = "FIXED_SIZE",
suffix = f'{unique_id}-f'
)

Scaling Strategy

Because Bedrock is serverless and fully managed:
Current Capacity Supports:
  • elastic ingestion of documents
  • auto-scaling vector retrieval
  • multiple data sources (up to 5 per Knowledge Base)
  • instant access to thousands of document chunks
Future Scaling Plan:
  • multi-knowledge-base federation for large enterprises
  • multi-model routing (Haiku for cheap Q&A, Sonnet for analytics, Opus for legal reasoning)
  • DLA for real-time document updates without full re-sync
  • automated RAG scoring using RAGAS
  • hybrid search across departments and geographies
  • role-based retrieval controls for privacy boundaries
This enables continuous scaling without re-architecting core infrastructure.

Evaluating RAG Quality Using the RAGAS Framework

RAG is not complete until it is measurable. RAGAS provides metrics such as:
  • Faithfulness — is the answer supported by retrieved text?
  • Answer relevance — how relevant is the answer to the prompt?
  • Context recall — how well did retrieval retrieve correct facts?
  • Context precision — are retrieved chunks prioritized correctly?
  • Semantic similarity & correctness
  • Entity recall and critique
  • Safety and harmlessness
Using these metrics, teams can:
  • validate quality at scale
  • run A/B retrieval configurations
  • reduce hallucination rates
  • continuously improve RAG accuracy

Responsible AI: Guardrails + Contextual Grounding

Enterprise AI requires more than accuracy — it requires governance, compliance, and safety.

Guardrails for Bedrock

Guardrails can:
  • block unsafe topics
  • redact sensitive content (PII, customer identifiers)
  • prevent harmful or abusive outputs
  • filter profanity or inappropriate language
  • enforce policy rules automatically

Contextual Grounding

This feature analyzes whether the model’s answer is supported by retrieved evidence and can:
  • block unsupported hallucinations
  • warn the user
  • request more retrieval
  • enforce accuracy thresholds
Together:
Retrieve responsibly → Generate responsibly → Govern responsibly
